Lesson 26 of 37Module 9

Build a Model-Driven RAG Agent

Let source reads guide the next retrieval action

Run Gemini-selected search and read actions, assess missing source details, enforce retrieval limits and compare cited answers with a fixed RAG baseline.

Prerequisites

Search/read tools, query refinement, retrieval-agent limits and the comparison of scripted policies with fixed pipelines from this module.

By the end, you can

  • Run model-selected search and read actions against a pinned documentation snapshot.
  • Separate model source assessment from application admission and citation checks.
  • Compare source retrieval, generated answers and action traces with a fixed baseline.
Runtime
Python 3.11+; SQLite with FTS5

Progress is saved in this browser.

Build a retrieval agent whose next action is selected by a language model. The earlier query-refinement lab introduced handwritten rules before its model-driven extension. Here Gemini reads observations, assesses what is missing, and chooses another search, a passage read, a cited answer or an incomplete stop.

The recorded live API comparison used 40 Gemini requests. Both paths passed the same number of authored answer checks; the agent also made an extra search for the JSON-and-file task. The unsuccessful trials stay in the report. This small corpus demonstrates the mechanism, not a general advantage for agents.

When you need this. Use this loop when a question may need another source read and you need a trace of why the model searched again.

Prerequisites. Complete the retrieval-policy comparison. Use Python with SQLite FTS5. The default replay needs no key, model download or external package. Fresh inference uses a Gemini API key and may incur charges.

1. Follow the two paths through the same sources

A fixed RAG pipeline chooses its retrieval sequence in code. This baseline searches the original question once, reads its top candidates, and asks the model to answer or stop. An agentic RAG application lets a model select later retrieval actions from the observations it has received.

An observation is a tool result accepted by the application. Search returns candidate metadata; only read returns source text. A source assessment is the model’s statement about what the passages do or do not support. It can be wrong. This implementation uses the same model for assessment, tool selection and final generation; a separate evaluator agent is optional architecture, not a requirement.

One model performs source assessment, action selection and answer generation. Yellow files are the pinned documentation snapshot; pink marks stop/refusal outcomes. Application code admits tool calls and validates citations. A stop, limit or failure returns no answer. Both paths still need independent answer checks.

Both paths use the same versioned Python-documentation summaries and lexical backend. This lab adapts the original search/read exercise to literal multi-term OR search, with version filtering before the result limit. It does not add vector search, external browsing or source switching. The existing hybrid retrieval lesson covers a different retrieval backend.

2. Admit actions before executing them

Download the complete lab. The controller, backend, fixtures, provider recordings and offline tests are included. Run these commands in its extracted directory:

Replay the exact requests and run offline testsTerminal · bash
python3 run.py
python3 -m unittest discover -v

The controller retains the original question and requested version. Each model request contains accepted observations and remaining counters. The model returns a structured action, but application code validates its fields and resolves read requests only to previously issued source handles.

Unknown action. A request for a tool outside search/read fails before execution. Unissued source. The model cannot read an arbitrary source ID. Changed read. The inherited receipt-bound validation rejects changed passage text before it becomes an observation.

Search allowance. An action that exceeds its search count is denied before calling the backend. Source-byte allowance. The controller obtains read size from validated metadata before invoking read. These bytes count source text, not the full model request or model tokens. Admitted failed attempts still consume allowance.

Repeated action. Equivalent search terms or an already-read source stop with a recorded failure. Call or time limit. Exhaustion returns incomplete without a candidate answer. The HTTP timeout is capped by the remaining per-run deadline. A synchronous tool call itself has no process cancellation boundary; this is a small local CLI, not a deployed worker service.

3. Inspect the passages before searching again

The JSON-and-file task needs passages about both JSON serialization and writing the resulting string. The model does not receive expected source labels or answer patterns. It must inspect its observations before deciding whether its source support is sufficient.

ActionQuery or sourceModel assessment
searchjson dump ensure_ascii utf-8Find the documentation for json.dump or json.dumps regarding ensure_ascii and saving to a UTF-8 file.
readjson-textNeed to check documentation on json serialization with ensure_ascii and writing to a UTF-8 file.
readpath-readNeed to check path-read or search for writing to a file in UTF-8 to combine with json.dumps(ensure_ascii=False).
searchwrite_text encoding utf-8 openWe need documentation on writing/saving text to a UTF-8 file (e.g. Path.write_text or open/json.dump with utf-8 encoding).
readpath-writeNeed documentation on writing text with UTF-8 encoding (such as Path.write_text or open) to answer how to save the serialized string to a UTF-8 file.
answer—We have sufficient evidence from `json-text` and `path-write` explaining how to keep non-ASCII characters when serializing to JSON and how to write that string to a UTF-8 file.

The model’s second search is selected after reading earlier results. This is the feedback loop that the scripted lessons prepared for. The controller supplies validated read text directly in later model requests, within its source-byte allowance; there is no additional context-builder service.

Missing details. The version-specific source names the newline parameter but does not explain its behavior or UTF-8 selection. The fixed model stopped. One agent run proposed an equivalent query and was refused; another searched again and eventually stopped. A read of the expected source is not enough to answer every part of a question.

4. Generate a cited answer and check its limits

An answer action includes the generated explanation and exact quotes. The application checks that every cited ID was read and every quote exists in that passage. URLs come from the validated source record, never a model-invented link.

Unread or changed citation. An unknown source or altered quote fails without returning the proposed answer. Passing this contract still does not show that every claim follows from the quote.

The backup-retention question exposes that boundary. Both paths cited a true statement about overwriting files, then asserted that no backups are retained. The supplied passage does not establish a retention policy. Our authored task expects abstention, so those answers fail the fixture check even though their citations pass. Do not turn an absent statement into a supported negative claim.

Recorded Gemini answer after iterative retrievalRecorded output · text
To serialize an object while keeping non-ASCII characters in the JSON string, use `json.dumps(obj, ensure_ascii=False)`. You can then save that string to a UTF-8 encoded file using `Path.write_text(data, encoding="utf-8")`.

5. Compare retrieval, answers and trajectories separately

The questions and checks were frozen before the first live call. Development and held-out labels stay outside model inputs. The held-out questions were authored with the same small corpus in mind, so this is an instructional split, not a measurement of unseen-domain performance. There were no prompt changes between repeats.

Retrieval checks look for the labelled source reads. Answer checks require expected source citations and configured answer patterns, or explicit abstention for the unsupported case. Pattern checks are narrow and can miss an incorrect explanation. Trajectory checks retain queries, decisions, tool observations and counters. Unit and contract tests use controlled responses to exercise guards; they are separate from the live model trials.

The agent recorded 4 passes, 3 failures and 1 incomplete trials. The fixed baseline recorded 4 passes, 2 failures and 2 incomplete trials. The report retains model usage and elapsed time. Billing cost was not measured. These repeats show behavior variation without estimating a success rate.

6. Replay recordings or make an explicitly bounded live run

Replay checks each complete request body against its saved original before returning the recorded reply. Changing a question, prompt, schema or observation causes a mismatch. It re-executes retrieval and validation; it does not measure new model behavior or current API availability.

Changed replay request. A saved response cannot be reused against different context. Batch allowance. The provider refuses another HTTP attempt when its process-wide request allowance is exhausted. It makes no automatic retries, including after HTTP errors or unfinished generation.

python3 run.py --live --execute-approved

The current live plan permits at most 200 API requests with Gemini 3.8 Flash and LOW thinking, plus output and request-body byte caps. The saved comparison used an earlier 80-request allowance and stopped after its actual requests shown above; raising that allowance did not trigger more inference. It exposes only the local documentation tools. This is structured JSON action selection implemented by our controller, rather than provider-native function calling. Fresh execution replaces the run records, so copy the lab before experimenting. A model alias can change; each original response retains its returned model version.

What’s next

Return to application integration with a clear distinction between the scripted policy and this model-selected loop. To integrate it into a server, add cancellation, authorization and concurrency admission around the same controller. Those service behaviors were not measured in this CLI.

Checked on 25 October 2026: Gemini structured outputs documents JSON schema output; GenerateContent documents the request and response fields. Schema conformance does not show that the passages support an answer. Gemini thinking describes thinking controls; the exact LOW setting and model version are retained in each recorded exchange. SQLite FTS5 documents lexical MATCH and BM25 ranking. The corpus consists of the preceding lab’s original summaries, not a fresh documentation crawl.
