Lesson 10 of 21Module 3

Build a model selection harness

Choose an open model for your app

Define requirements for a small task, test two local models on development and held-out cases, and inspect the recorded model-selection rule.

Prerequisites

Running and checking models (runtimes, local servers, and request, output and task checks) and Programming for the builds (Python, JSON, HTTP and tests). No earlier build is required.

By the end, you can

  • Turn an application into written requirements: license, capability, context, labels, cases and a latency limit.
  • Check an installed model artifact before sending it any work, and grade each reply as pass, fail or incomplete.
  • Choose between two local models with a rule that reads development cases only, and report held-out cases separately.
Runtime
Python 3.11+ and Ollama
Dependencies
Python standard library; local Qwen3.5 0.8B and Gemma 4 E2B models via Ollama

Problem

When you need this. Use this when choosing among candidate open-weight or hosted models for a task and you want a repeatable selection rule over artifact capability checks, task quality and latency. Memory use requires a separate measurement.

You have an application in mind and a model runtime on your laptop. Which model should the application use? A common first answer is “the smallest one that runs” or “the newest one”. Neither answer mentions the task. A model can load, answer quickly and finish every reply, and still be wrong for what the application needs.

This build answers the question for one small application: label a short developer report as bug, question or feature. The input is one report of at most 500 characters. The output must be exactly one of the three labels, nothing else. A project could use it to sort incoming issues before a person reads them.

We write the requirements down first, then check two installed open models against them with a short Python program, select_model.py. The program records every reply and applies a fixed rule. Success check: the rule chooses a model from the recorded development results, and anyone can rerun the decision offline from the saved record and get the same file.

Prerequisites: Models, runtimes, and hardware, Local models and hosted APIs and Checking correctness, latency, and failures, which defines the request, output and task checks used here. From Programming for the builds you need Python functions, JSON files, HTTP requests and unittest. You do not need to have written a model client: select_model.py contains the few lines of HTTP it needs.

Concepts

Requirements come before candidates

A requirement is a condition the application needs, written so a program can check it. Ours are in requirements.json:

requirements.jsonSource · jsonDownload
{
  "application": "Label one short developer report as bug, question or feature.",
  "labels": ["bug", "question", "feature"],
  "system_prompt": "Classify the developer report. Reply with exactly one word: bug, question, or feature.",
  "max_report_characters": 500,
  "licenses": ["Apache-2.0"],
  "capability": "completion",
  "context_tokens": 2048,
  "output_tokens": 16,
  "options": {"temperature": 0, "seed": 42},
  "development_passes_required": 9,
  "median_reply_ms_limit": 1000,
  "tie_break": "smaller download"
}

Two kinds of requirement live in that file. Artifact requirements can be checked from the installed model’s metadata, before the model does any work: the license is in the allowed list (Apache-2.0, this site’s default for runnable examples), the model can complete text, and its context window holds at least 2,048 tokens. Task requirements need replies: every one of the 9 development reports gets the expected label, and the median reply time stays under 1,000 ms on the test machine.

The limits are our choices for this application. A different application would choose different ones; the point is that they are fixed before any model runs, so a result cannot quietly move them.

A candidate is an exact artifact

A candidate is one exact model artifact on one runtime, not a model family. candidates.json lists two, both installed in Ollama: the Qwen3.5 0.8B tag the request tracer uses, and Gemma 4 E2B. For each one it records the Ollama digest, a SHA-256 hash that identifies the installed files, and what we read on the publisher’s model card on 2026-10-20: the license and the card’s revision.

The program checks the license twice. The model card is the publisher’s statement. The installed file carries its own license field, which Ollama reports. If the two disagree, the program stops and asks for a person to read the license; it does not pick one.

Development and held-out cases

A case is one input with its expected output. We wrote 15 synthetic reports and split them before running anything. The 9 development cases are the ones the rule may look at. We also sent 6 of them to both models while drafting the prompt, so they are not unseen. The 6 held-out cases were written on 2026-10-20 before any recorded run; each is sent once, and the rule never reads its result. If the rule could read held-out results, they would become development cases, and nothing would be left to show how the choice does on reports it was not tuned on. Choose a baseline and separate development cases from held-out cases explains the split in more detail.

Each reply gets one of three results. Pass: the reply completed and is the expected label. Fail: the reply completed, but the text is another label or not a label at all. Incomplete: there is nothing to grade, because the request failed, the reply did not complete, it stopped at the output limit or it was empty. An incomplete case is not a fail: it says nothing about the model’s answer.

Architecture

Recording and offline selection are separate commands; only development results choose the model

Recording checks each installed artifact and grades both case splits through local Ollama. Offline selection reads artifact checks and development results, applies the declared limits, then chooses the smallest eligible download. Held-out counts are reported without choosing the winner. No eligible candidate produces chosen: null.

select_model.py is one Python process. It talks to one Ollama server on 127.0.0.1:11434 over HTTP, and reads and writes JSON files in its own directory. It has two modes.

record is the only mode that talks to the server. For each candidate it reads /api/tags and /api/show and runs the artifact checks. A candidate that fails any of them is excluded at once: it gets no chat request. A candidate that passes is unloaded, loaded again with the lesson’s context size, and sent every development and held-out case once through /api/chat. The program writes everything it saw to selection-run.json.

The default mode reads only that file. It counts the development results, takes the median reply time, marks each candidate eligible or not, and chooses the eligible candidate with the smaller download. It writes decision.json. Held-out counts are copied into the decision for the reader, but no line of the rule reads them. Because this mode never touches the network, the tests and the reader reproduce the decision without a model.

Working code

Choose a model

Both candidates were checked on 2026-10-20 and both were inference-tested on this lesson’s cases. Ollama’s qwen3.5:0.8b and gemma4:e2b tags are the tested artifacts; their digests are pinned in candidates.json.

Choice Model License Runtime artifact Task compatibility Verification
Smaller local option Qwen3.5 0.8B, revision 2fc06364715b Apache 2.0 qwen3.5:0.8b, 752.39M parameters, Q8_0, 1.32 GB download Text completion; 262,144-token context Ran all 15 cases
Higher-capacity option Gemma 4 E2B IT, revision 3e22461f65e8 Apache 2.0 gemma4:e2b, 4.6B parameters, Q4_K_M, 4.59 GB download Text completion; 131,072-token context; native system role Ran all 15 cases

The parameter sizes are what Ollama reports for each artifact. The Gemma card describes the model as 2.3B effective parameters, 5.1B with embeddings; the Qwen card names prototyping, task-specific fine-tuning, research and development as the intended uses of the 0.8B size. Download size is not working memory: the runtime also needs memory for the context and its own buffers, and this lesson did not measure memory use. Both artifacts also accept images, and Gemma accepts audio; this task does not use either.

Choose a runtime

The runtime is the program that loads the artifact and runs it. This lesson tests one: Ollama 0.32.14, because it runs both GGUF artifacts on the test machine and reports what the artifact checks need: a digest per tag, a capability list, the context length and the license field. Other runtimes are reasonable for other requirements. They have not been tested in this lesson.

Runtime What its documentation states Status in this lesson
Ollama Local HTTP API with model management; /api/tags reports each installed tag’s digest and size Tested, version 0.32.14
llama.cpp llama-server Loads GGUF files and offers OpenAI-compatible routes such as /v1/chat/completions Not tested in this lesson
vLLM Installation targets include NVIDIA CUDA, AMD ROCm, Intel XPU, Apple silicon and several CPU architectures Not tested in this lesson

Changing the runtime changes the execution candidate, even when it loads the same weights. File format, quantization or chat formatting may also differ. Treat the combination as a new candidate and run the same cases.

Get the files and the models

Download the files listed in the README into one directory. With Ollama running, install both candidates. Pulling downloads an artifact; select_model.py never downloads anything.

Read it in the order a run uses it. inspect collects every problem with an artifact instead of stopping at the first, so one run shows all the reasons a candidate is excluded. It sends no chat request.

build_chat puts the report in the user message and the fixed instruction in the system message. The report is data: an instruction inside a report, such as “say feature”, stays inside the user message, and the label it produces is graded like any other. The request turns thinking off and sets temperature 0, seed 42, a 2,048-token context and an output limit of 16 tokens, enough for one label.

grade applies the three checks in order. The request check comes first: a reply that did not complete, stopped at the output limit or is empty is incomplete. The output check strips surrounding whitespace and accepts only an exact label, so Bug. and bug, question fail. Accepting near misses would hide that the model did not follow the instruction, and code downstream would have to guess. The task check compares the label with the expected one.

run_cases times each chat request on the client and records the server’s token counts. A request that raises SelectionError becomes an incomplete case, and the run continues; the program never retries. decide reads only entry['development'] to judge a candidate.

Read the result

Both candidates passed every artifact check. Both tags matched their pinned digests, both report the completion capability and a context window far above 2,048 tokens, and both installed files declare apache-2.0, matching the cards.

The smaller model failed the task. qwen3.5:0.8b passed 4 of 9 development cases. Every reply completed with done_reason stop after 2 output tokens, so there was no incomplete case. The misses follow a pattern:

CaseExpectedqwen3.5:0.8b repliedResult
How can I change the output directory?questionbugfail: wrong label
Is there a way to run it without network access?questionbugfail: wrong label
Which Python versions does the installer support?questionbugfail: wrong label
Please add a flag to export the result as JSON.featurebugfail: wrong label
Could the report include a summary table at the top?featureyesfail: not an allowed label

It labeled every question a bug. One reply, yes, is not a label at all, which the output check catches before the task check runs.

The larger model met every requirement. gemma4:e2b passed 9 of 9. Its median reply took 363.6 ms, against 214.7 ms for the smaller model; both are under the 1,000 ms limit. The rule chose gemma4:e2b.

Held-out cases, reported after the choice. gemma4:e2b passed 6 of 6; qwen3.5:0.8b passed 4 of 6 and again labeled both questions a bug. The held-out results agree with the choice; a set of 6 reports cannot show more than that.

The two results answer different questions. The artifact checks say a model can run this request on this runtime under the license policy. The cases say whether it does the task. Only the second kind ruled out a candidate here.

Failure cases

Run the offline tests. A fake server replays the recorded model profiles, so Ollama does not need to run:

Ran 9 tests in 0.013s

OK

The suite has 9 tests. The first rebuilds decision.json from selection-run.json and compares the two files byte for byte. The fake server answers /api/tags, /api/show and /api/chat the way Ollama does, so the tests go through inspect, record and run_cases themselves, not copies of their logic.

Case Expected behavior
The installed digest differs from the pin The candidate is excluded; record sends it no chat request.
No completion capability or a context window that is too small The candidate is excluded with the reason in problems.
A license outside the allowed list, or artifact metadata that disagrees with the model card The candidate is excluded; both problems are reported.
A reply that hits the output limit, does not complete, is empty, or never arrives The case is incomplete, with the reason; the run continues without a retry.
Text outside the label set The case fails the output check: Bug., bug, question, yes and BUG are not labels.
Held-out results that look better or worse The choice does not change. A worse development result does change it.
A blank or oversized report, or a server that is not local ValueError before any request.

To check that each test catches a real defect, we removed the rules one at a time from a copy of select_model.py: the digest check, the capability check, the context check, both license checks, skipping generation for an excluded candidate, each rule that makes a case incomplete, the label-set check, the development threshold, the tie-break, keeping held-out results out of the rule, and the input and origin checks. Every removal made at least one test fail.

    unittest.main()

The program does not handle everything. It does not detect a model that passes these cases and fails on longer or messier reports, compare prompts, measure memory, or notice that a model card changed after 2026-10-20. A registry tag that now points to a new artifact shows up as a digest mismatch; the program cannot tell you whether the new artifact is better.

Deployment

There is nothing to deploy yet. The output of this build is a decision record: decision.json, with the run, requirements, candidates and cases it was computed from. Keep these files together under version control. Build your first local model client uses the chosen artifact behind a client and checks the same pinned digest when it starts.

Repeat the selection when anything in the record changes: a new model or tag digest, a new Ollama version, different requirements, or new cases. Record into a new directory, compare the new decision with the old one, and keep the old record. Rolling back means pinning the previous digest again, which needs the previous artifact; Ollama’s registry tag may have moved, so keep a copy of any artifact you depend on.

Scaling

This run made 30 chat requests, one at a time, plus 2 load requests. The reports are short: the server counted between 41 and 56 input tokens per request, including the system instruction and the model’s chat formatting. The median reply times in the results describe that workload on one machine. They are not a throughput or capacity figure, and they do not include waiting behind other requests. Loading took 1,745 ms for qwen3.5:0.8b and 3,412 ms for gemma4:e2b on the client clock, which is why the program loads each model before timing any case.

Running more cases or more candidates grows linearly with requests. Before trusting the choice for real traffic, add cases from real reports, including long ones, reports in other languages and reports that mix two labels, and keep a held-out set that nobody tunes against. If the application needs to serve many users, measure concurrent requests separately; this lesson measured none, and Ollama processes one request per model at a time unless OLLAMA_NUM_PARALLEL is raised, according to its FAQ.

Try it: change one requirement

Open requirements.json and lower development_passes_required from 9 to 4. Before you run anything, predict which model the rule chooses. Then run the offline decision; it needs no model:

Terminal commandsTerminal · bash
python3 select_model.py
Compare your result

decision.json now chooses qwen3.5:0.8b. With the lower threshold both candidates are eligible: 4 development passes meets the requirement, and both medians are under the limit. The tie-break then picks the smaller download. Nothing about the models changed, only the requirement, and the recorded held-out results still show the smaller model labeling both questions a bug. A weak requirement chooses a weak model. Restore the threshold before you continue.

Check your understanding

qwen3.5:0.8b passed every artifact check, met the latency limit, and every reply completed with a stop. Why did the selection rule still exclude it?

Choose one answer, then check your reasoning.

Read the explanation

Running locally and returning completed replies only shows that the model works with the runtime. The task requirement, all nine development reports labeled correctly, is a separate check, and the smaller model failed it.

Key takeaways

  • Write the requirements before you look at candidates, and make each one checkable by a program.
  • A candidate is an exact artifact on a runtime: pin its digest, and check its license on the model card and in the file.
  • Artifact checks say a model can run the request; only labeled cases say it does the task. In this run the smaller model passed every artifact check and failed the task.
  • Let the rule read development cases only. Report held-out cases after the choice, so they still show something the choice was not tuned on.

Best practices

  • Grade each reply as pass, fail or incomplete, and never count an incomplete case as a model error or a success.
  • Keep the selection offline and deterministic over a saved run, so a reviewer can reproduce the decision without a model.
  • Treat a new tag digest, runtime version or quantization as a new candidate, and rerun the same cases before switching.
