Lesson 4 of 6

Build a RAG pipeline with citations

Retrieve internal developer documentation with PGVectorStore, ask Gemini for source IDs and quotes, and reject citations outside the supplied chunks.

Prerequisites

Python, JSON, SQL tables and vector similarity. The lab README lists model and database setup; saved-vector tests need no API key.

By the end, you can

  • Retrieve source-labelled documentation chunks through PGVectorStore.
  • Request typed Gemini answers with citations or an explicit abstention.
  • Reject unavailable source IDs and invented excerpts while identifying the limits of those checks.
Runtime
Python 3.12+ and PostgreSQL 17 with pgvector
Dependencies
LangChain PostgreSQL, Ollama and Gemini integrations; NumPy; Pillow (locked versions in the download)

Lab code, tests and fixtures (ZIP, 257 KB)Quiz check your understanding

You will retrieve internal developer documentation with PGVectorStore and ask Gemini for an answer with source IDs and quoted text. Application checks reject IDs and excerpts that do not belong to the supplied chunks. In the recorded three-question run, two questions receive cited answers and one question with no source answer receives an abstention.

When you need this. A developer assistant must let a reader inspect the procedure behind its answer. A plausible-looking link is not enough: the cited chunk must have been available to the model, and its quoted words must exist.

PGVectorStore retrieves chunks for a developer question. Gemini sees only those chunks and returns an answer with source IDs and quotes. Application checks reject unknown IDs or nonmatching excerpts; they do not grade the claim.

1. Retrieve the text the model will see

Download the complete lab, extract it and open a terminal in build-a-rag-pipeline-with-citations/. The README lists its runtime and recorded examples.

Prepare the local labTerminal · bash
python3 -m venv .venv
source .venv/bin/activate
python -m pip install -r library-requirements-lock.txt

rag.py checks the current model digest and document settings against the embedding manifest. It then loads the supplied internal documentation through PGVectorStore, retrieves three chunks for the platform team and passes those exact chunks to answer_question().

import json
from pathlib import Path
import sys
from ollama import Client
from library import DocsEmbeddings, MODEL, answer_question, check_identity, documents, identity, vector_store
from pg_cluster import Cluster
ROOT=Path(__file__).parent

def main(question:str):
    chunks=documents()
    digest=next(m.digest for m in Client().list().models if m.model==MODEL)
    saved=json.loads((ROOT/'vectors.json').read_text())
    check_identity(saved['identity'],identity(chunks,digest))
    embeddings=DocsEmbeddings(model=MODEL)
    with Cluster() as pg:
        with vector_store(pg.url,embeddings) as store:
            store.add_documents(chunks,ids=[d.id for d in chunks])
            selected=store.similarity_search(question,k=3,filter={'team':'platform'})
            result=answer_question(question,selected)
            if result['citation_error']:
                raise ValueError(result['citation_error'])
    print(json.dumps(result,indent=2,default=str))
if __name__=='__main__': main(sys.argv[1] if len(sys.argv)>1 else 'How do I roll back a service?')

Each supplied source has a chunk source_id, a human-readable document path and its text. The model cannot cite another source merely because that source exists somewhere in the database. Retrieval limits what reaches the prompt; it does not establish that the selected chunks answer the question.

Run a fresh answer after installing the lab dependencies and configuring your existing Gemini API key in GOOGLE_API_KEY or GEMINI_API_KEY:

Terminal commandsTerminal · bash
.venv/bin/python rag.py "How do I roll back a service?"

The program uses the existing local embedding model and Gemini Developer API. It creates and removes its own PostgreSQL cluster; it does not connect to a production database. No key belongs in the downloaded source or recorded output.

2. Ask for a typed answer or an abstention

ChatGoogleGenerativeAI.with_structured_output(Answer, method="json_schema", include_raw=True) requests a typed response. Answer contains a status, answer text and citations; every citation has a source ID and quote. Parsing errors are handled before the application checks.

The system message asks the model to use not_in_sources when the supplied chunks lack an answer. That is an instruction, not an enforced truth detector. The application can enforce the response shape, but it cannot determine from the status field alone whether the question was answerable.

An abstention still cites a source. validate_citations() rejects this contradictory shape. Ask again only after deciding whether the missing information should be retrieved or the answer should remain absent; a retry alone adds no source material.

3. Check IDs and contiguous excerpts

A citation names an unretrieved chunk. The checker builds its allow-list from the chunks passed to this model call. An ID outside that set is rejected, even if it names another indexed document.

A quote joins separated words. The checker normalizes whitespace and requires a contiguous excerpt of at least four words. It does not remove punctuation or reorder text. Two correct fragments joined into one invented quote fail the test; retrieve a chunk containing the complete excerpt or quote a shorter contiguous passage.

An answer has no citations. An answered response needs at least one citation. This is an application rule for this interface, not a claim that the presence of a citation makes an answer correct.

4. Read the three recorded answers

The saved run uses Gemini 3.8 Flash at provider sampling defaults, once per question. The rollback answer quotes the previous-digest instruction. The page-deletion answer explains that stored chunks still need deletion. The Friday-approver question returns not_in_sources, because the supplied documents do not name an approver.

A valid quote accompanies a false claim. A regression test attaches a real deployment excerpt to the false claim that rollback always reverses database migrations. The citation checker accepts its source and quote. That test demonstrates a limit, not a desired answer: structural citation checks do not grade whether the claim follows from the text. Human review or a separately evaluated entailment check is still needed.
