Lesson 6 of 6

Inspect cosine distance under the hood

Use NumPy and saved real embeddings to inspect cosine distance, reject invalid vector shapes, and see why metadata filters still matter.

Prerequisites

Python, JSON and vector similarity. Install the locked Python dependencies; the saved-vector calculation needs no database, model server or API key.

By the end, you can

  • Calculate cosine distance over saved real embeddings with NumPy.
  • Refuse zero, non-finite and mismatched-dimension vectors before sorting.
  • Distinguish vector distance from the candidate filter and answer relevance.
Runtime
Python 3.12+
Dependencies
NumPy and the locked LangChain adapters imported by library.py; no running PostgreSQL, Ollama or Gemini service needed

This optional lesson uses NumPy to inspect the cosine distance behind the library search. You will compare one saved developer question with the 16 real document vectors and sort the distances. The main application continues to use PGVectorStore; this calculation is for understanding its vector ordering.

When you need this. A search result surprises you and you want to distinguish the distance calculation from filtering, chunk choice and answer generation.

For each saved vector, NumPy divides the dot product with the query by both vector lengths. Sorting one minus this cosine similarity returns the nearest chunks. This optional calculation explains the distance used by the library.

1. Read the saved vector shapes

Download the complete lab, extract it and open a terminal in build-exact-vector-search/. The README lists its runtime and recorded examples.

Prepare the local labTerminal · bash
python3 -m venv .venv
source .venv/bin/activate
python -m pip install -r library-requirements-lock.txt

The matrix has one row per chunk and 1024 columns. The question has one 1024-number vector produced with the same Qwen model and query instruction. No embedding or generation call runs in this lesson.

The code uses the document order in docs.json and retrieves each saved vector by its exact chunk text. The recording adapter refuses unknown text rather than substituting a random or zero vector.

2. Divide by both vector lengths

Cosine similarity is the dot product divided by the product of the two vector lengths. Cosine distance is one minus that similarity. Smaller distance means a closer direction in this embedding space; it is not a probability that the passage is correct.

Vectors have different lengths. A raw dot product changes when a vector is scaled. Dividing by both lengths makes the cosine comparison unchanged by positive scaling. The regression test checks that a scaled query and scaled document keep the expected distances. Do not rely on a model always returning unit-length vectors unless that behavior is part of the model interface you checked.

A vector has a different dimension. Refuse it before matrix multiplication. Equal dimensions are necessary for this calculation but do not establish that the vectors came from the same model or input format.

A vector is zero or non-finite. A zero vector makes the denominator zero; NaN can spoil sorting without an obvious exception. The function checks finiteness and nonzero lengths before dividing.

3. Sort distances and inspect the source

np.argsort(..., kind="stable") orders the distances. A stable sort preserves input order for equal values; it does not decide which tied document is more useful. The recording returns the platform rollback chunk first, followed by a data-team rollback chunk and an API-key chunk.

That second result illustrates why vector closeness is only one part of search. This calculation has no team filter. The PostgreSQL lab includes a platform-team predicate, so its ranked set differs. Do not compare filtered and unfiltered top-three lists as though they were the same query.

The function scores every saved vector and sorts the whole result. It is a transparent small calculation, not an approximate index, persistent store or replacement for the library path. The HNSW and IVFFlat lesson examines those mechanisms through pgvector.

The closest three unfiltered vectors differ from the platform-filtered database results. Is that necessarily a distance bug?

Choose one answer, then check your reasoning.
